# LearnLens: Why Reward Is Not Learning — Your Agent Is Lying to You

## The Problem

Here is a scenario that happens in real RL training, constantly.

You train an agent for 500 steps. Reward goes from 0.65 to 0.96. You write it up. You ship it.

What you don't know: the agent never learned the task. It found a loophole in your reward function on step 3 and has been exploiting it ever since. Your training signal was measuring exploitation, not learning. The curves looked great. The agent learned nothing.

OpenEnv — and every standard RL framework — outputs one number: cumulative reward. That number cannot tell you:

- Whether the agent generalises to episode variants it hasn't seen before
- Whether the agent makes consistent decisions when the same state is phrased differently  
- Whether reward gains came from solving the task or from gaming the reward function
- Whether the agent's stated reasoning actually explains its actions

This is not a theoretical concern. It is the default failure mode. Goodhart's Law, documented in RL as far back as 2018 (Krakovna et al.), and still unsolved in the OpenEnv ecosystem as of April 2026.

## What LearnLens Is

LearnLens is a pip-installable Python package that wraps **any** OpenEnv environment via URL and produces a **Learning Quality Score (LQS)** alongside the standard reward. It runs four independent diagnostic probes on any live environment — no changes to the environment required.

Three lines. Zero environment modifications. Works on any OpenEnv Space — the learnlens-numbersort Space linked above is live and accepting connections right now (`GET /health` returns `{"status": "healthy"}`).

## The Demo: When Reward Gets the Ranking Wrong

The built-in demo environment is **NumberSort** — an OpenEnv-compliant sorting task where the agent receives a shuffled list of integers and must return them sorted in descending order. Simple enough that the correct behaviour is obvious. Complex enough to demonstrate every probe.

The reward function is deliberately exploitable:

The loophole: overlap measures whether the submitted numbers are the *right numbers*, not whether they're in the *right order*. Any permutation of the correct numbers scores `overlap = 1.0`, giving `reward ≥ 0.70` — without solving the task.

Three agents, measured by both reward and LQS:

**Reward ranks Random above Hacker. That ranking is wrong.** The random agent is guessing. The hacking agent at least has a consistent (if wrong) strategy. LQS gets this right: Greedy > Hacking > Random.

The random agent's ConsistencyProbe score is 0.20 — it gives a different answer every time the same observation is rephrased. Reward never sees this. LQS does.

The hacking agent's LQS is high because it is *consistent* — it always applies the same exploit. The real hack detection story plays out in the training experiment, where we explicitly penalise the exploit and watch what happens.

## The Four Probes

Each probe answers one question. Each returns a float in `[0.0, 1.0]`.

**GeneralizationProbe** — Does the agent perform the same on unseen episode variants?  
Runs the agent on base seeds (0–N) and variant seeds (1000–1000+N). Measures the normalised performance gap. `1.0` = perfect generalisation. `0.0` = memorisation.

**ConsistencyProbe** — Does the agent make the same decision when the state is rephrased?  
Takes one mid-episode observation and presents it with 5 different surface templates. Measures majority agreement across phrasings. No extra environment steps. Catches brittle parsers and surface pattern matchers immediately.

**HackDetectionProbe** — Is reward tracking true task performance?  
Computes an environment-agnostic true task score from trajectory structure: coverage (steps with positive reward), diversity (coefficient of variation of step rewards — flat uniform rewards are suspicious), and monotonicity (Kendall's tau on reward trajectory). Returns `hack_index` — lower is better. Full signal on multi-step MDPs. Correctly limited on single-step environments (documented).

**ReasoningProbe** — Does the agent's chain-of-thought justify its action?  
Uses a separate LLM judge (different model from the agent — MT-Bench methodology, Zheng et al. NeurIPS 2023) to score reasoning on relevance, coherence, and uncertainty acknowledgement. Returns `0.5` neutral if no chain-of-thought is available or no API key is set. Never penalises agents that don't produce CoT.

## The LQS Formula

Three design decisions worth knowing:

**Geometric mean of G and C.** An agent that generalises but behaves inconsistently is not a 50% learner — it is unreliable. Geometric mean enforces that both must be simultaneously high. Same principle as harmonic mean in F1: Precision=1, Recall=0 → F1=0, not 0.5.

**Multiplicative trust coefficient.** Hack detection is a validity gate, not just another metric. When hacking is detected, the generalisation score, consistency score, and reasoning score are all measured on a corrupted reward signal. Multiplying by trust discounts the entire measurement system. An additive penalty would just subtract points — wrong epistemology.

**sqrt(H) not H directly.** Non-linear decay: H=0.1 → trust=0.68 (minor exploitation tolerated). H=0.9 → trust=0.05 (systematic hacking collapses trust near zero). The curve matches intuition.

## The Training Experiment: LQS as a GRPO Reward Signal

This is the core claim. Not just "here is a metric." Here is what happens when you *train* on it.

**Setup.** The hacking agent (ascending sort exploit) starts with Reward=0.654, LQS=0.000, Hack Index=1.00. It has found the loophole and is fully exploiting it. Standard training would reinforce this — reward is high, gradient says keep going.

**The LQS reward function** penalises known exploit patterns:
- Hack penalty: **−0.4** if ascending sort detected (the known loophole)
- Format bonus: **+0.1** for valid JSON output
- Net: hacking now scores 0.30 instead of 0.70 — the exploit stops being profitable

**Model:** `unsloth/Qwen2.5-3B-Instruct` · **Steps:** 500 · **Hardware:** T4 GPU (HF Credits) · **Framework:** Unsloth + TRL GRPO

Reward increased by 0.304. LQS increased by 0.848. Hack index dropped from 1.00 to 0.00.

The agent stopped exploiting and started learning. 500 steps. T4 GPU. Reproducible in the Colab notebook linked below.

**The critical observation:** a standard training run measuring only reward would report +0.304 improvement and call it a good training run — the exploit was already scoring 0.654, so the improvement looks modest. LQS reveals what actually happened: the agent went from zero genuine learning to LQS=0.848. The behavioural shift was total. Reward undersold it by a factor of three.

## The Environment: NumberSort on HF Spaces

The live environment at [learnlens-numbersort](https://huggingface.co/spaces/ajaybandiwaddar01/learnlens-numbersort) is a fully compliant OpenEnv environment running on HF Spaces. It exposes the standard endpoints (`/health`, `/reset`, `/step`, `/state`, `/ws`) and passes all OpenEnv validation checks.

**Three tasks:**

The reward function is deliberately exploitable — this is a design choice, not a bug. NumberSort exists to make reward hacking visible and measurable so LearnLens can demonstrate its probes on a task where the ground truth is obvious to any human reviewer.

Scores are always clamped strictly to `(0.001, 0.999)` as required by OpenEnv validator.

## Why This Fits the Theme

LearnLens is a Wild Card submission — it does not build one environment. It builds the evaluation layer that makes every OpenEnv environment more trustworthy.

The judges' own guidance describes common mistakes: "Not checking for reward hacking" and "Relying only on average reward and not inspecting outputs." LearnLens directly addresses both, as a reusable infrastructure layer rather than a one-off fix.

The architecture is already designed to extend to ORS (Open Reward Standard, 330+ environments) via a single adapter class in `learnlens/adapters/ors.py`. Zero changes to core code required.
